Variational Bayes for Hierarchical Mixture Models

چکیده
In recent years, sparse classification problems have emerged in many fields of study. Finite mixture models have been developed to facilitate Bayesian inference where parameter sparsity is substantial. Classification with finite mixture models is based on the posterior expectation of latent indicator variables. These quantities are typically estimated using the expectation-maximization (EM) algorithm in an empirical Bayes approach or Markov chain Monte Carlo (MCMC) in a fully Bayesian approach. MCMC is limited in applicability where high-dimensional data are involved because its sampling-based nature leads to slow computations and hard-to-monitor convergence. In this article, we investigate the feasibility and performance of variational Bayes (VB) approximation in a fully Bayesian framework. We apply the VB approach to fully Bayesian versions of several finite mixture models that have been proposed in bioinformatics, and find that it achieves desirable speed and accuracy in sparse classification with finite mixture models for high-dimensional data. Supplementary materials for this article that contain detailed technical derivations are available online.

Hierarchical Model Selection for NGnet Based on Variational Bayes Inference
This article presents a variational Bayes inference for normalized Gaussian network, which is a kind of mixture models of local experts. In order to search for the optimal model structure, we develop a hierarchical model selection method. The performance of our method is evaluated by using function approximation and nonlinear dynamical system identification problems. Our method achieved better ...
متن کاملProfile Predictive Inference
Bayesian predictive inference analyzes a dataset to make predictions about new observations. When a model does not match the data, predictive accuracy su ers. We develop population empirical Bayes ( ), a hierarchical framework that explicitly models the empirical population distribution as part of Bayesian analysis. We introduce a new concept, the latent dataset, as a hierarchical variable and ...

In this paper, we empirically analyze the behaviors of the Variational Bayes algorithm for the mixture model. While the Variational Bayesian learning has provided computational tractability and good generalization performance in many applications, little has been done to investigate its properties. Recently, the stochastic complexity of mixture models in the Variational Bayesian learning was cl...

Bayesian predictive inference analyzes a dataset to make predictions about new observations. When a model does notmatch the data, predictive accuracy suffers. We develop population empirical Bayes (pop-eb), a hierarchical framework that explicitly models the empirical population distribution as part of Bayesian analysis. متن کاملProperties of variational estimates of a mixture model for random graphs
Mixture models for random graphs have a complex dependency structure and a likelihood which is not computable even for moderate size networks. Variational and variational Bayes techniques are useful approaches for statistical inference of such complex models but their theoretical properties are not well known. We give a result about the consistency of variational estimates of the parameters of ...
